RecurTrace: looped AI that remembers and knows when to stop
What happened
arXiv paper 2609.03379, submitted 3 September 2026 by Yuxiang Wang and collaborators, introduces RecurTrace: a way to turn a pretrained language model into a memory-augmented looped reasoner with adaptive halting. Latent looping reuses a middle block of layers to add effective depth without emitting extra tokens. Two problems usually blunt that trick: each loop only sees the previous output and forgets earlier passes, and a fixed loop count wastes depth on easy inputs while starving hard ones.
RecurTrace answers both with the loop’s own trajectory. Loop Memory Attention lets each looped layer attend to its own states from previous iterations along a loop-time axis, so the model can revisit earlier computations. A halting head reads the loop state and predicts whether another pass will still help; it is supervised by an oracle that marks depths where extra loops still reduce loss. On a controlled MathQA comparison with a 1.7B looped backbone, RecurTrace reaches 56.9% accuracy at an average of about 2.0 loops, beating the best fixed loop depth by 2.2 points at matched compute.
ACT and PonderNet collapse to one loop in the paper’s tables; CALM spends more loops for less accuracy; stronger baselines such as LoopUS-Conf and TaH-Mismatch still land lower. Gains also appear over same-budget fine-tuned baselines from 0.6B to 8B, with the accuracy lift growing with scale.
